Adapting robotic policies to dynamic environments is one of the most complex challenges in reinforcement learning. Traditional residual reinforcement learning (RL) methods apply additive corrections to a pre-trained policy, assuming that the deviation between the original action distribution and the required one is simply a shift. However, this approach fails when the shape, scale, or geometry of the distribution must change in response to an alteration in the system dynamics. The innovative approach known as Warp RL solves this limitation by replacing additive corrections with invertible, state-conditioned transformations using rational-quadratic spline flows. This allows modifying the action distribution of the base policy more flexibly, preserving identity initialization and generalizing the additive method. In manipulation tasks with controlled changes in dynamics, Warp RL matches the performance of residual corrections when a shift is sufficient, but greatly surpasses them when reshaping the distribution is required. Furthermore, in sim-to-real pipelines, it achieves a comparable success rate with 30% less time in real peg insertions.
